The first approach (Section ref{sec:supervised} describes how we have developed an efficient method that allows us to train supervised deep learning models using active learning. The second approach (Section ref{sec:unsupervised}) describes how we have proposed an unsupervised learning method which aims at solving multi-label classification problems using multi-modal data. In both approaches we have used deep neural networks as classifiers. In particular we have considered Convolutional Neural Networks (CNNs) as well as Recurrent Neural Networks (RNNs). CNNs are neural networks which perform convolutions over input data. They are particularly suited when dealing with images or videos since they take advantage of local spatial correlations between pixels. RNNs are neural networks which process sequences iteratively. They are particularly suited when dealing with temporal data such as videos or speech signals. The two approaches described here use deep learning methods differently. In particular: begin{itemize} item In Section ref{sec:supervised} we propose an active learning method which uses CNNs or RNNs as classifiers. However these networks are not trained end-to-end. Instead they are used as feature extractors. Their parameters are kept fixed during training. We show how this allows us to efficiently select samples from an unlabeled pool that will maximize accuracy improvement if labeled by an oracle. item In Section ref{sec:unsupervised} we propose an unsupervised learning method which uses CNNs or RNNs as classifiers. These networks are trained end-to-end using only unlabeled data. The loss function used during training encourages these networks learn representations which capture both intra-class similarities (i.e., samples from different modalities belonging to same class should be similar) as well as inter-class differences (i.e., samples from different classes should be dissimilar). end{itemize} The remainder of this chapter summarizes our contributions: begin{itemize} item Section ref{sec:contributions} describes our main contributions; item Section ref{sec:future_work} discusses possible future work; item Section ref{sec:final_thoughts} contains final thoughts about my PhD studies. end{itemize} section{Contributions} label{sec:contributions} My main contributions during my PhD studies can be summarized as follows: begin{enumerate} item I proposed an active learning method that allows us train CNNs or RNNs using very few labeled samples (see Section ref{sec:active_learning}). This method selects samples from an unlabeled pool that will maximize accuracy improvement if labeled by an oracle. The key idea behind this approach is that we can use CNNs or RNNs as feature extractors whose parameters are kept fixed during training. Our method can be applied whenever we want to train CNNs or RNNs but we have access only to limited amount of labeled data. This makes it particularly suited for medical applications where labeling data is usually very costly. We tested our approach on several benchmarks including image classification (CIFAR-10), video classification (HMDB51), image segmentation (PASCAL VOC 2012), action recognition (UCF101), activity recognition (THUMOS14) and emotion recognition (EmotioNet). Our experiments show that: begin{enumerate} item Our method performs better than standard active learning baselines; item Our method performs better than standard semi-supervised baselines; item Our method outperforms fully supervised methods when trained using small amount of labeled data; end{enumerate} Furthermore our experiments show that our method allows us reduce labeling cost by up-to $90$% while keeping accuracy degradation below $5$% compared with fully supervised methods trained using all available labeled data.
